Evolutionary Learning Systems for Real and Artificial Environments

I coordinated the research project Evolutionary Learning Systems for Real and Artificial Environments (Ewolucyjne systemy uczące się w środowiskach rzeczywistych i wirtualnych), granted by the Polish Ministry for Science and Higher Education (grant #N N519 3505 33, 2007-2010).

Major results

The project Evolutionary Learning Systems for Virtual and Real-world Environments combined two important topics of computational intelligence: bio-inspired computing (in particular, evolutionary computation), and machine learning. Other important research directions studied in this project included artificial life and pattern recognition.

The objective of the project was the development of, mostly bio-inspired, learning algorithms for intelligent agents that operate in various environments. Examples of such learning agents considered in the project include: control systems ('brains') and designs ('bodies') of virtual agents, machine learning classifiers, pattern recognition systems, game-playing agents, and real-world, physical robots. The project embraced development of theory and algorithms, as well as applications in selected areas.

The main scientific results of this project include: new algorithms for knowledge sharing among agents trained using evolutionary computation (cross-task knowledge sharing and reuse) and their hybridization with a new method of object recognition based on genetic programming (generative evolutionary pattern recognition); fuzzy rule-based controllers optimized using evolutinary computation; a variant of evolutionary algorithm that does not explicitly involve fitness function (fitnessless coevolution) and its application to a non-trivial one-person game; theoretical contributions to the concept of coordinate systems for so-called test-based problems and new coevolutionary algorithms that rely on that concept (COSA); hybridization of coevolutionary algorithms with local search algorithms implemented as temporal-difference learning (CTDL) and its application to learning of game strategies for the games of Othello and Go; investigations into semantics in genetic programming and their exploitation in new recombination operators (semantic crossover) and fitness function (co-solvability fitness function); the concept of functional modularity for genetic programming and its application to problem decomposition; machine learning induction algorithms for problems with imbalanced distribution of decision classes and dispersed minority class (SPIDER) and algorithms for generating artificial problems for this research domain; new results in combining rule-based classifiers induced using selected algorithms (MODLEM) into metaclassifiers (compound classifiers); novel algorithms for detection and description of sequential patterns (Context Mapping Improved); new measures for characterizing the individuals evolved in artificial life experiments; computer implementations of biological models and processes; mobile robot based on the PPRK platform, equipped with a camera and enabled with evolutionary visual learning aimed at visual navigation; software library for coevolutionary algorithms (CoEvolutionary Computation in Java, cECJ); applications of the proposed algorithms to optimization of construction and control systems of agents that operate in virtual environments (artificial life) and in the real world (the mobile robot), and in pattern recognition (detection of vehicles in satellite imagery, recognition of handwritten characters, recognition of hand-drawn shapes); also, a few review and summary papers.

In total, the project resulted in 36 scientific publications, including 33 peer-reviewed contributions: 10 papers in journals cited in ISI/JCR indexes, 6 papers in Springer LNCS/LNAI series, 4 chapters in books, 12 papers in proceedings of top-class international conferences (including GECCO, Genetic and Evolutionary Computation Conference, CEC, IEEE Congress on Evolutionary Computation, DaWaK, Data Warehousing and Knowledge Discovery, and IEEE-CIG, IEEE Symposium on Computational Intelligence and Games), and 1 paper in proceedings of Polish national conference. Also, two Master's theses and three research reports have been written within the project.

Projekt łączył głównie wątki badawcze reprezentujące dwie gałęzie inteligencji obliczeniowej: obliczenia ewolucyjne oraz uczenie maszynowe. Inne wątki wyraźnie obecne w pracach projektowych to sztuczne życie oraz rozpoznawanie obrazów. Celem badań było rozwijanie (najczęściej inspirowanych biologicznie) algorytmów których zadaniem jest uczenie (optymalizacja) agentów operujących w różnych środowiskach. Przykładami takich agentów rozważanych w projekcie są: systemy sterowania i konstrukcje symulowane w środowiskach wirtualnych, systemy klasyfikujące, systemy rozpoznające obrazy, strategie gier, oraz rzeczywiste roboty. Projekt obejmował zarówno prace o charakterze podstawowym (teoria, nowe algorytmy, reprezentacje i operatory genetyczne), prace eksperymentalne, oraz wybrane zastosowania.

Główne wyniki naukowe projektu to: nowe algorytmy współdzielenia wiedzy pomiędzy agentami uczącymi się w sposób ewolucyjny (cross-task knowledge sharing and reuse) oraz ich hybrydyzacja z nową generatywną metodą rozpoznawania obrazów bazującą na programowaniu genetycznym; rozmyte algorytmy sterowania uczone algorytmami ewolucyjnymi; koncepcja koewolucji pozbawionej jawnej funkcji przystosowania (fitnessless coevolution) oraz jej udane zastosowanie do uczenia się strategii w nietrywialnej grze jednoosobowej; nowe algorytmy koewolucyjne wykorzystujące koncepcję układu współrzędnych (COSA) oraz prace teoretyczne dotyczące podstaw tychże układów współrzędnych; podejście hybrydyzujące algorytmy koewolucyjne z przeszukiwaniem lokalnym realizowanym za pomocą uczenia ze wzmacnianiem (CTDL) oraz jego zastosowanie do uczenia się strategii gry Otello i Go; studia nad semantykami w programowaniu genetycznym oraz ich wykorzystanie w konstruowaniu nowych operatorów krzyżowania (semantic crossover) i funkcji przystosowania (co-solvability fitness function); koncepcja modularności funkcjonalnej dla programowania genetycznego jako metody dekompozycji złożonych problemów na prostsze podproblemy; algorytmy uczenia maszynowego specjalizowane dla problemów z niezrównoważonym rozkładem klas decyzyjnych i rozproszoną klasą mniejszościową (SPIDER) oraz generatory sztucznych problemów niezbędne do prowadzenia badań w tym obszarze; prace nad wykorzystaniem wybranych algorytmów generowania reguł decyzyjnych (MODLEM) w klasyfikatorach złożonych; algorytmy eksploracji wzorców sekwencyjnych (Context Mapping Improved); nowe miary opisujące rozwiązania otrzymane w wyniku symulowanej ewolucji w ramach eksperymentów sztucznego życia; implementacje modeli zjawisk i procesów biologicznych; wyposażony w kamerę robot mobilny oparty na platformie PPRK, oprogramowany w sposób umożliwiający ewolucyjne uczenie się poprzez interakcję z otoczeniem; biblioteka obliczeń koewolucyjnych cECJ; udane zastosowania opracowanych metod do zadań optymalizacji konstrukcji i systemów sterujących agentów operujących w środowiskach wirtualnych (sztuczne życie) i rzeczywistych (robot mobilny), oraz rozpoznawaniu obrazów (detekcja pojazdów w obrazowaniu lotniczym, rozpoznawanie ręcznie pisanych znaków i ręcznie rysowanych figur geometrycznych), a ponadto prace o charakterze przeglądowym, edukacyjnym i popularnonaukowym.

W ramach projektu powstało 35 publikacji, w tym 33 prace recenzowane: 10 artykułów w czasopismach, 6 artykułów w seriach wydawniczych LNCS/LNAI, 4 rozdziały w anglojęzycznych pracach zbiorowych, 12 publikacji w recenzowanych materiałach konferencyjnych konferencji międzynarodowych, 1 publikacja w recenzowanych materiałach konferencyjnych konferencji krajowej. Ponadto w trakcie badań powstały 2 prace magisterskie i 2 raporty techniczne.

Zdecydowana większość wyników osiągniętych w ramach realizacji projektu została zaprezentowana na renomowanych konferencjach międzynarodowych, w tym: GECCO (Genetic and Evolutionary Computation Conference), CEC (IEEE Congress on Evolutionary Computation), multikonferencji Evo*, konferencji DaWaK (Data Warehousing and Knowledge Discovery), ISA (International Conference on Information Security and Assurance) oraz IEEE-CIG (IEEE Symposium on Computational Intelligence and Games).

W wyniku prac prowadzonych w ramach projektu powstał program, który zwyciężył konkurs Balanced Diet zorganizowany przy konferencji GECCO (Atlanta, Georgia, 2008). Jedna z prac magisterskich realizowanych w ramach projektu zdobyła II nagrodę w XXVI edycji Ogólnopolskiego Konkursu Polskiego Towarzystwa Informatycznego na najlepsze prace magisterskie z informatyki. Efektem implementacyjnym projektu jest także otwarta biblioteka obliczeń koewolucyjnych cECJ (ang. Coevolutionary Computation in Java) oraz strona WWW projektu.
